Introduction

In AI, the evolution of decision-making systems is shaped by the need to handle complex and uncertain environments. As agents become more advanced, they require better models, more effective strategies for action selection, and the ability to modify and adapt their decision-making processes. This blog explores how AI agents evolve through the lens of intelligence potentiation, highlighting the specific decision-making features hyperpolated by evolution at each stage that progressively make AI agents more intelligent and adaptable. We can think of the evolution here as an AI engineer trying to create the worlds best NPC for a game, each new version is selected over the older, less persuasive one.

1. Reflex Agents: The Origin of Decision-Making

The foundation of intelligence potentiation begins with the most basic type of agent: the reflex agent. Reflex agents operate in fully observable environments, where they respond to input stimuli using predefined rules—if X happens, then do Y. This is essentially a hardcoded decision-making process that works only in static, predictable environments.

While reflex agents can efficiently handle simple tasks, their decision-making capabilities are severely limited. They lack flexibility, adaptability, and the ability to learn or reason about novel situations. They cannot deal with uncertainty or partial information, and their behavior is entirely reactive.

2. Model-Based Reflex Agents: Managing Uncertainty

As environments become more complex and less predictable, reflex-based decision-making becomes inadequate. In AI, these goals represent the agent’s long-term objectives, which drive its decision-making process. However, goal-based agents typically rely on exhaustive search to evaluate all possible actions, which is computationally expensive and inefficient.

Potentiation direction: Introduce efficiency by enabling agents to rely on heuristics or intuitive judgment to limit the search for optimal decisions.


4. Satisficing Agents: Efficient Decision-Making

As intelligence potentiates, AI agents evolve from exhaustive search to more satisficing approaches. Rather than searching through every possible action, the agent relies on intuition and heuristics to guide its decision-making. This is akin to human System 2 thinking, where decisions are based on gut feelings or rules of thumb that are “good enough” rather than optimal.

This step significantly improves decision-making efficiency, allowing the agent to prioritize decisions that are likely to work without spending excessive time evaluating every possibility. However, while the agent can now search more intelligently, it still lacks the ability to imagine new scenarios outside of its current experience.

Potentiation direction: Introduce the ability to imagine novel situations, enabling the agent to project beyond its first order experience.


5. Agents with Imagination: Expanding the Decision Space

The next potentiation of intelligence introduces the ability to interpolate new situations with its world model. An agent that can generate hypothetical scenarios can now simulate somewhat new environments or unseen challenges in its decision-making process. This ability to reason about situations beyond its immediate experience gives the agent a major advantage in handling unseen challenges.

However, while the agent can now imagine different outcomes, its world model remains static and is not modified in light of new information or simulations. To further potentiate intelligence, the agent must be able to modify and update its world model based on new information.

6. Self-Modifying Agents: Adapting the World Model

Despite this improvement, the agent’s ability to modify its world model is still uninformed. Without the proper memory systems, the agent cannot accurately integrate knowledge from multiple domains to dynamically weight and contextualize changes to the world model.

Potentiation direction: Introduce robust memory systems (semantic, episodic, working memory) to provide the agent with better context for its decisions.


7. Memory-Enhanced Agents: Contextual Decision-Making

Memory is a crucial component of intelligent decision-making. By equipping the agent with episodic, semantic, and working memory, we provide it with the ability to recall past experiences, access factual knowledge, and hold information in mind while making decisions. These memory systems enable the agent to make decisions that are more informed and context-sensitive, improving its ability to modify its world model accurately.

At this stage, the agent is still limited in its capacity to reflect on its own thinking. To further potentiate intelligence, the agent must be capable of metacognition—thinking about its own decision-making process.

Potentiation direction: Equip the agent with metacognition, enabling it to reflect on and optimize its decision-making strategies.


8. Metacognitive Agents: Reflecting on Decisions

With the introduction of metacognition, the agent now has the ability to reflect on its own thinking process. This self-awareness allows the agent to recognize when its decision-making strategies are flawed and to adjust them accordingly. Metacognitive agents can evaluate and optimize their decision-making, improving their performance over time.

Although metacognition enhances self-awareness, the agent is still reliant on external tasks to guide its decision-making. It lacks the ability to generate its own problems or engage in curiosity-driven exploration.

9. Curiosity-Driven Agents: Autonomous Problem Generation

Curiosity is the hallmark of truly advanced decision-making systems. By fostering curiosity, the agent becomes a self-directed learner, actively seeking out new experiences and generating its own problems to solve. This allows the agent to explore informative challenges, expanding its decision-making horizons and improving its ability to adapt to new situations.

However, at this stage, problem generation is still somewhat random. The agent needs a mechanism to prioritize problems based on their potential to improve decision-making.

Potentiation direction: Introduce mechanisms for evaluating and prioritizing problems based on their potential for learning and informativeness.


10. Prioritization and Abstract Causal Reasoning

As curiosity-driven agents evolve, they require the ability to evaluate the problems they generate and prioritize those that offer the most value in terms of learning. By incorporating causal reasoning, the agent can now reason about cause-and-effect relationships, understanding why certain actions lead to specific outcomes and extrapolate.

Abstract reasoning potentiates intelligence by allowing the agent to use abstract concepts and principles that transcend specific experiences. This form of reasoning enables the agent to work with generalized ideas that apply across a wide range of scenarios, helping it recognize patterns and build higher-level frameworks. Abstract reasoning is foundational to understanding, but it is limited by the agent's ability to generate such generalizations in very unfamiliar, dynamic situations that deviate from learned distributions.

This form of reasoning still misses the ability to consciously integrate fundamentally new experiences causally and to generate these abstractions on the fly. The agent lacks the flexibility needed for real-time problem-solving in novel situations that differ significantly from its previous experience.

Potentiation direction: Introduce fluid intelligence to enable the agent to apply abstract reasoning flexibly and causally bind new experiences in real-time.


11. Full Fluid Intelligence: Conscious Causal Adaptation

Fluid intelligence refers to the ability to solve new problems by applying flexible and creative thinking. It enables the agent to generalize its knowledge and adapt to situations that differ significantly from what it has previously encountered. More importantly, it involves the recurrent causal binding of fundamentally new experiences (finding new dimensions that order real experience or virtual experience, simulated from exploratory causal reasoning) and consciously forming causal abstractions on the fly, allowing the agent to update its internal models dynamically and hyperpolate new causal information in real-time.

This process is critical for handling truely novel situations, as it allows the agent to consciously adjust its abstract reasoning and apply it effectively in contexts it has never encountered before. Fluid intelligence enhances the agent’s ability to solve problems that require adaptability, creativity, and causal integration. In theory, using the mind-building algorithm called p-consciousness, it should even afford the integration of new senses, plugged into the brain, like Neuralink. It ensures that decision-making remains 'open-minded' and ready to think 'outside of the box', unlike static foundation models, which are huge, duct taped, unconscious boxes:
